is there real world benefits once we hit these speeds? Is it like stepping up from HDD to SSD?
I work with mixture of SSD and NVMe based computers at home and at work (both SSDs and NVMes' I use are Samsung). NVMe provides a great boost in some specific instances (like file copies), but generally there isn't much in it… I think a lot of things are bottle necked by CPU rather than storage speed. The benefit is not drastic like going from HDD to SSD (except in file copies and loading some games). I've found Office applications, browsers and Visual Studio don't get any improvement in start up times or performance.
Having said that, I find SOME older games load a LOT quicker on my Samsung 960 Pro NVMe than my 2xSSD in RAID 0.
